Sales and Use Tax Exemption

We have a Sales and Use Tax Exemption Certification and do not pay sales tax on products purchased for resale on Amazon. Considering that the shipping box is part of the sale of the actual item sold, would shipping supplies (boxes, tape, etc.) purchased for the sole purpose to ship out these items also be exempt from sales tax when we purchase them?

In short - when we buy boxes to ship out sold inventory, should we be paying sales tax on those types of supplies?

You have to have a tax-exempt form, this is different from a re-sale certificate. Also, depending on the state(s) you are selling to, you most likely need a re-sale cert from each state to avoid taxes in that state (research Nexus for the state(s), which will tell you if you need one or not.

That will depend on the rules for your state. Some states allow these to be purchased without tax, other states require you to pay tax on them. Check with your specific state tax authority.
